Would it be more useful for an undergrad to take math courses like real analysis, differential equations, etc. or stats courses like time series, stochastic calculus, etc.?

Statistics are part of mathematics. And you can't do statistics without having basic knowledge of other areas of mathematics so I guess it depends on your current level.

I see way too many undergrads taking machine learning and deep learning courses before learning calculus or linear algebra.

Learn math fundamentals - real analysis, algebra and linear algebra - first. Linear algebra is most important as all of machine learning basically rely on it. Then take intro to stats courses, linear regression and machine learning. Also make sure to have strong cs fundamentals. Esoteric stats knowledge (various tests, arima garch etc) will not be useful for interviews and you can always look into it later if you ever need it.
